본 논문에서는 도시가스 배관안전을 위해 기계학습(machine learning)과 심화학습(deep learning)을 사용한 배관압력 예측모델을 제안한다. 도시가스 배관은 지중에 매설되어 있기 때문에 점검의 간격이 길고 세부적인 관리가 어려우며 굴착공사에 안전이 노출되어 있다. 이러한 배관의 상태를 점검하고 관리하기 위해 사용하고 있는 방법들 중 하나는 정압기(gas pressure regulator)에서 측정하는 배관의 압력 수치로 배관이상을 판단하는 방법이다. 도시가스사의 기존 시스템에서는 배관의 압력 수치가 기준 수치를 초과하거나 그에 미치지 못할 경우 배관이상으로 판단하는데, 외부환경이나 상황과 무관한 획일화된 기준을 적용함으로 인하여 불필요한 이상 경보가 발생하기도 한다. 본 연구는 도시가스 배관압력 예측모델을 통해 전문가의 이상탐지의사결정에 도움을 주는 것을 목적으로 한다. 전문가는 모델이 제공하는 예측압력 데이터를 기반으로 배관의 압력 이상 여부를 예상하고 대비할 수 있으며 또한 배관 이상 경보 발생 기준 수치를 상황에 따라 유연하게 조절할 수 있다. 배관압력 데이터는 국내 도시가스 공급업체 중 하나인 중부도시가스사의 데이터를 사용한다. 중부도시가스사의 배관압력 데이터는 정압기에서 측정한 배관의 1차 압력, 2차 압력 수치로, 감시 제어 및 데이터 취득(supervisory control and data acquisition, SCADA) 시스템에서 수집, 관리된다. 배관압력 데이터는 주기성을 가지고 있기 때문에 이를 활용하기 위해 변수를 생성해 사용한다. 주기성에 대한 파생변수는 이동평균과 특정기간 이전 동일시점의 수치를 사용한다. 더불어 외부환경의 영향을 분석에 사용하기 위해 도시가스 사용량에 영향을 미치는 기상요인, 인구통계, 유가, 시간정보를 추가적으로 수집한다. 배관압력 데이터와 시간변수, 외부환경변수를 통합한 후에는 데이터 수집기간의 불일치로 인해 존재하는 결측값(missingvalue)을 처리하고, 독립변수들에 정규화 작업을 진행한다. 통합 데이터를 전처리(pre-processing)한 후에는 많은 변수들 중 특징값들을 추출하기 위해 주성분 분석(principal component analysis, PCA)을 실행한다. 본 연구에서는 배관압력 수치를 예측하기 위해 회귀모델을 구현한다. 기계학습 알고리즘 중 random forest와 support vector regression(SVR)을 사용하고, 심화학습 알고리즘 중에서는 시계열 데이터 분석에 적합한 long-short term memory(LSTM) 알고리즘을 사용한다. 통합, 전처리를 한 데이터 셋과 세 알고리즘을 사용해 중부도시가스 공급권역 별 일, 시간 단위 배관압력 예측모델을 각각 구성한다. 각 모델의 성능평가 결과 LSTM을 사용해 구현한 일, 시간 단위 배관압력 예측모델에서 가장 낮은 평균 제곱근 오차(root mean square error, RMSE)와 절대 평균 백분율 오차(mean absolute percentage error, MAPE)를 가지며 우수한 성능을 보인다.

In this research, a system for city gas pipeline pressure prediction model is proposed. Most of the gas pipeline is buried underground. Because of this, the time intervals between pipeline inspections are long, and the management of pipeline is difficult. One of the pipeline management methods is to manage gas pipeline pressure using pressure regulator. Existing system uses reference values to detect gas pipeline pressure anomaly. The system makes alarm event when the pressure is higher or lower than reference values, but this uniformed values causes unnecessary alarm events. This research proposes a system that helps with gas pipeline pressure anomaly detection by analyzing and predicting pressures. Experts can make decisions about pipeline anomaly detection and adjust reference values about pressure alarm events. The gas pipeline data of Jungbu City Gas Company, which is one of the domestic city gas suppliers, is analyzed and prediction models are made. The primary pressure and secondary pressure from pressure regulators are collected and managed through a supervisory control and data acquisition (SCADA) system. The pressure data is combined with time and other environment variables to form a data set. To use the pressure data’s periodicity in this analysis, time variables are derived. The time variables are moving average and the values before fixed periods, the highest and lowest values for fixed periods. The environment variables are the weather, oil prices, birth data, holidays, weekends, and seasonal data. For combined data set, the missing values are filled and the values are scaled. The principal component analysis (PCA) is applied to combined dataset. In this research, regression models are proposed. Among machine learning algorithms, random forest and support vector regression (SVR) are used, and among deep learning algorithms, long-short term memory (LSTM) algorithm is used to create pipeline pressure prediction models. A comparison of daily pressure prediction models’ performances shows that the LSTM model, which had a RMSE 0.02, MAPE 1.008, was the best. A comparison of timely pressure prediction models’ performances shows that the LSTM model, which had a RMSE 0.011, MAPE 0.442 was the best.
