When modeling quantitative microstructure physical property relationships (QMPRs), it would be helpful if the microstructural input and output were in the form of visual images rather than parameterized descriptors. However, only a typical supervised learning technique would be insufficient to build up a real-image-based PMPR model. Generative adversarial network (GAN) is necessary to achieve such a promising PMPR model that adopts visual images as input and output data. Recently developed GAN-based deep-learning techniques such as a deep convolutional generative adversarial network (DCGAN), a cycle-consistent generative adversarial network (Cycle GAN), and a conditional GAN-based image to image translation (Pix2Pix) could be of great help via the creation of realistic microstructures. In this regard, we generated virtual micrographs for various types of steel and for Li-ion battery materials using a DCGAN, a Cycle GAN, and a Pix2Pix with the intention of utilizing them for QMPR models. In Chap. 5, A data-driven approach based on machine learning (ML) techniques has recently been established in metallurgy research. Most ML approaches in the field have been focused on the build-up for reliable quantitative models elucidating a definite relationship between materials condition and performance. The input feature in such a model involves alloy compositions, crystal structure, microstructures, processing (heat/mechanical) histories, and other conditions, and the output feature designates the materials performance such as mechanical and functional properties. In general, the input feature dimension (the number of material conditions) is much higher than the output feature dimension (the number of materials property of concern). Once a reliable ML model was set up, the prediction of material performances from given material conditions would be easily achieved. It is true, however, that such a prediction is not very useful for practical engineering. What would really interest us should be an inverse prediction, so-called an inverse design modeling, wherein required material conditions should be deduced from a desired material property. This sort of inverse prediction necessitates an awkward ML model exhibiting a far less number of input features than that of output features. Rather than such an inverse ML model that would never work out, we realized inverse design by employing two approaches, a metaheuristics-assisted inverse prediction using a conventional deep neural network and an atypical DNN model based on the modified variational autoencoder.
