4차 산업혁명의 혁신적인 IT기술인 인공지능(AI)은 영상분석 및 음성분석, 자연어처리 등을 기반하여 점차 기업 경영의 핵심이라고 생각할 수 있는 인사노무의 채용 업무까지 그 범위를 넓혀가고 있다. 채용업무에서 사람에 의하여 대면 면접을 실시하는 방식 보다 더 편리한 인공지능(AI)에 의한 비대면 면접을 실시하는 ‘AI 채용시스템’이 등장하게 된 것이다. 그러한 변화가 가능하게 된 배경으로서 첫째, IT 기술의 발달에 따른 조직의 경영적 변화로 지원자들의 직무적합성과 업무 수행능력을 보다 과학적으로 분석할 수 있게 되었기 때문이며, 둘째, 최근 지속되고 있는 COVID-1 9 바이러스 팬데믹 때문에 언텍트(비대면) 방식의 도입이 권장되면서 AI 채용시스템을 도입하려고 시도하는 기업들이 증가하는 추세이다. 셋째, AI 채용시스템은 채용 업무의 성과와 비용 절감 측면에서 효율성을 높여준다. 넷째, 사회적 물의를 빚어왔던 공기업의 채용 비리 사건으로 채용 절차에 대해서 공정성과 객관성에 대한 논란이 가중되었고 공정하고 투명한 채용 절차에 대한 사회적 압박이 차츰 고조되어 왔기 때문이다. 이로 인해 채용 시장에서는 업무의 생산성과 효율성을 높인다는 목적으로 AI 채용시스템을 활용하는 기업들이 증가하고 있으며, AI를 기반으로 하는 지능형 도구는 지원자 관련 데이터를 수집·분석·처리하여 지원자의 정보를 업로드, 전형 단계 별 선발, 그리고 면접, 이력 추적 등 여러 업무 프로세스에서 업무의 실행 속도를 높이고 간소화할 수 있는 ‘인사 및 채용 자동화’ 단계까지 발전하고 있다. 그러나 채용 시장에서의 사회적 현상은 AI 채용시스템을 실제로 채용에 적용함으로써 얻을 수 있는 긍정적인 측면과는 반대로 사회적인 특정 제한 요인 또한 여전히 존재하고 있다. 그러한 사회적 제한 요인 가운데 첫째는, 채용 면접 지원자들 답변의 진실성에 관한 문제이다. 최대한 자신의 속마음이나 감정을 의도적으로 숨기려 하는 채용 지원자들 때문에 직무능력이나 역량을 정확하게 평가하려는 채용목표의 달성은 제한적이다. 바꿔 말하면, AI 채용시스템 운용에서 가장 먼저 부딪치는 장애 요인으로서 면접 과정에서 면접 지원자들의 암묵적인 속임수와 훈련된 의도적 거짓말에 대하여 진위여부를 파악하고 합리적인 의사결정으로 인재를 선발한다는 것이 현실적으로 불가능하다. 둘째는, AI 채용시스템에 탑재되는 알고리즘의 편향성에 대한 논쟁이다. AI 채용시스템의 알고리즘은 업무 고성과자들을 대상으로 실시된 면접 질문의 답변과 면접 대상자의 심신반응으로 구성된 트레이닝 데이터셋을 가지고 학습된다. 즉, 훈련 데이터를 수집할 때부터, 현실 업무에서 성과가 우수하다고 인정된 지원자를 대상으로 모의 면접을 실시해 질문에 대한 답변과 심신반응 데이터를 수집하기 때문에 기존의 채용 절차에 의하여 선발된 우수 업무성과자들의 집단적 또는 계층적 편향성에 영향을 받을 수밖에 없는 개연성이 존재한다. 따라서 현재로서는 AI 채용시스템 알고리즘의 공정성과 투명성에 대한 충분한 확신이 없는 상태에서 객관적으로 공정성을 높여줄 것이라고 막연히 단정짓기는 성급한 판단일 것이다. 셋째는, 최근 주목받고 있는 딥러닝 기반의 AI 채용시스템은 지원자의 최종 합격/불합격 여부를 판단하는 의사결정에 대하여 논리적 설명이 불가능하다는 이유에서 초래되는 사회적 신뢰성의 문제점이 있다. 비록 AI가 데이터를 수집, 처리하는 분석 기술로서 숨겨진 패턴과 상관관계, 기타 통찰력을 찾기 위해 데이터를 분석하는 기술로서는 탁월하지만, 분석 결과가 도출되기까지 데이터 분석의 각 단계마다 인과관계를 논리정연하게 설명하기 어려운 측면이 존재한다. 기존 AI 채용시스템은 머신러닝 모델을 기반으로 하는 음성과 얼굴의 영상을 분석하는 기술에 의하여 개발되었다. 그런데 현재까지 도입된 AI 채용시스템의 면접 평가 방법으로는 지원자들 답변의 진위여부까지 정확하게 판단하여 선발할 수 없다는 한계점이 존재하고 있다. 이에 본 연구에서는 지원자 답변의 진실과 거짓을 탐지해야 하는 문제에 집중하여 진위여부의 판별기준을 보다 객관적으로 탐구하기 위해 EEG 기반의 생체실험 연구를 제안하였다. 본 연구의 실험설계는 EEG에 기반하여 뇌 활동 패턴과 뇌 영역 간에 14채널의 뇌파 신호를 수집하는 생체학적 실험을 실시하여 실험에 응했던 면접대상자들 답변의 진실과 거짓의 진위여부를 탐지하는 연구 방법을 계획하였다. 본 연구의 실험 결과를 비교 분석하기 위한 분류 모델로서 Decision Tree, Random Forest, CNN 모델이 사용되었다. 세 가지 분류모델의 성능을 평가해 보면, Decision Tree 모델의 정밀도는 진실 0.68이며, 거짓 0.63이었고, 재현율은 진실 0.42이며, 거짓 0.82로 나타났고, F1-Score는 진실 0.54이며, 거짓 0.71이었다. Random Forest 모델의 정밀도는 진실 0.63, 거짓 0.69이며, 재현율은 진실 0.67, 거짓 0.65로 나타났고, F1-Score는 진실 0.65 거짓 0.67이었다. CNN 모델(Adam 알고리즘)의 정밀도는 진실 0.62이며, 거짓 0.70이었고, 재현율은 진실 0.69이며, 거짓 0.62로 나타났고, F1-Score는 진실 0.66이며, 거짓 0.66이었다. CNN 모델(SGD 알고리즘)의 정밀도는 진실 0.53이며, 거짓 0.79이었고, 재현율은 진실 0.60이며, 거짓 0.71로 나타났고, F1-Score는 진실 0.71이며, 거짓 0.60이었다. CNN 모델(RMSprop 알고리즘)은 정밀도는 진실 0.77이며, 거짓 0.61이었고, 재현율은 진실 0.34이며, 거짓 0.91로 나타났고, F1-Score는 진실 0.47이며, 거짓 0.73이었다. 실험 결과로서 Decision Tree, Random Forest, CNN 모델 모두 비슷한 성능을 보여주었으며, 그 중에서도 CNN 모델의 성능이 상대적으로 우수하였다. 인구통계적인 관점에서 조사하기 위하여 구직자 10명의 데이터만을 분석해 보았을 때에 Decision Tree의 정밀도는 진실 0.75이며, 거짓 0.63이었고, 재현율은 진실 0.63이며, 거짓 0.75로 나타났고, F1-Score는 진실 0.68이며, 거짓 0.68이었다. CNN의 정밀도는 진실 0.82이며, 거짓 0.73이었고, 재현율은 진실 0.75이며, 거짓 0.80로 나타났고, F1-Score는 진실 0.78이며, 거짓 0.76이었다. 비구직자를 포함했던 총 60명의 데이터보다 구직자 10명의 데이터를 가지고 분석해 본 결과는 세 가지 분류모델의 성능이 더 우수하게 나타났다. 그 중 CNN의 성능이 더 우수하게 나타났다. 이와 같은 결과를 통해 본 연구는 면접 지원자들의 진실성을 식별해 낼 수 있는 딥러닝 AI 알고리즘의 개발에 EEG 기반 데이터가 유효하다는 사실을 확인하였다. 본 연구를 통해 EEG 기반 AI 채용시스템의 개발 및 구현에 실질적 도움이 될 수 있는 중요한 단초를 제공하게 될 것이라고 예상하게 되었다.

Artificial intelligence (AI), an innovative IT technology of the 4th Industrial Revolution, is gradually expanding its scope to recruitment service. It can be considered one of the core task processes of corporate management, which uses an "AI recruitment system" based on image analysis, voice analysis, and natural language processing. The "AI recruitment system" has emerged and conducts non-face-to-face interviews using artificial intelligence (AI) which is more convenient than conducting face-to-face interviews by recruitment interviewers. As the background of this current assets change, the first reason is that the scientific analysis of an applicant's job performance has been possible by organizational management transformation which could resulted from applying IT technology to management sector. The second reason is that more companies are attempting to adopt AI recruitment systems because of the recent COVID-19 Virus Pandemic. The third reason is that an AI recruitment system increases work efficiency in terms of task performance and cost reduction in a human resource department. The fourth reason is that the social controversy over the hiring scandal caused by several public corporations increased gradual demand for fairness and objectivity in the hiring processes. As a result, more companies begin to adopt AI recruitment systems to improve workplace productivity and efficiency, and AI-based smart systems have been developing into a "human-resource-management and recruitment automation" stage at the end, which may speed up and simplify work processes such as resume uploading, screening, and tracking job history and untact interviewing. However, social phenomena in the recruitment market still have certain social obstacles including technological limits in opposition to the affirmative aspects regarding actually applying AI recruitment systems to hiring processes. The first of those social obstacles is the uncertainty about job interview applicants' integrity on the answers to interview questions. Many applicants are expected to make implicit deceit and trained disguise in pursuit of better achievement. Therefore, it is said that identifying interview applicants' integrity is almost impossible in reality and reaching reasonable decision making is unoffordable through interviewing in terms of accurate assessmment of applicants' job skills and competencies. Second, there exists an unsolved debate over the intrinsic bias of algorithms which is mounted on AI recruitment systems. The algorithm of the AI recruitment system is trained with a training dataset which consists of mental and physical (psychosomatic) responses which are obtained from workers with excellent job performance who applied to mock interviews. In other words, there could be inevitability that the training dataset may be affected by the collective or hierarchical bias of excellent job performers who are evaluated by the existing recruitment processes from the beginning of collecting training dataset. Therefore, it would be making a hasty judgment to vaguely conclude that AI recruitment system will objectively increase fairness without sufficient confidence in the fairness and transparency of its algorithm. Third, a deep learning-based AI recruitment system, which has recently attracted a greal deal of attention, has a problem of social reliability suspected by the fact that it is impossible to logically explain the cause and effect relationship to determine the final pass-or-fail of job applicants. Although AI is an excellent analysis technology that collects and processes and analyzes big data to find hidden patterns, correlations, and give insights into big data, it is truly impossible as yet to logically explain cause and effect relationship at each stage of data analysis until the analysis results are concluded. The existing AI recruitment system was developed based on a machine learning model, a complicated technology that analyzes voice and face images with big data. However, the interview evaluation method of the AI recruitment system adopted so far has a limitation in that it cannot accurately determine the applicants' answer truthfulness during interviews. To solve the applicants' integrity problem in this study, an EEG-based biological experiment was proposed to more objectively explore the criteria for determining integrity by focusing on how to identify either the truth or falsehood of applicant's answers. The experimental design of this study was based on such EEG signal that its biological experiment was conducted to collect 14 channels of EEG signals between brain activity patterns over brain regions to set up a research methodology which is useful in identifying the truth or falseness of the interviewees' answer. Decision Tree, Random Forest, and CNN models were used as classification models to compare and analyze the experimental results of this study. By evaluating the performance of the three classification models, it was found that Decision Tree model's precision was true 0.68 and false 0.63, and its recall was true 0.42 and false 0.82, and its F1-Score was true 0.54 and false 0.71. In case of Random Forest model, its precision was true 0.63 and false 0.69, and its recall was true 0.67 and false 0.65, and its F1-Score was true 0.65 and false 0.67. In case of CNN model (Adam optimizer), its precision was true 0.62 and false 0.70, and its recall was true 0.69 and false 0.62, and its F1-Score was true 0.66 and false 0.66. In case of CNN model (SGD optimizer), its precision was true 0.53 and false 0.79, and its recall was true 0.60 and false 0.71, and its F1-Score was true 0.71 and false 0.60. In case of CNN model (RMSprop optimizer), its precision was true 0.77 and false 0.61 and its recall was true 0.34 and false 0.91, and its F1-Score was true 0.47 and false 0.73. Comparing performance results showed that Decision Tree, Random Forest, and CNN models all showed similar performance. However, CNN model's performance was relatively more excellent among them. To investigate from a demographic perspective, the analysis of 10 job seekers' EEG data was conducted and CNN model showed better performance in all of the three classification models than compared with the analysis of the total data consisting of 57 people who participated in this study's experiment whether job seeker or not. In that comparion, the precision of the Decision Tree was true 0.75 and false 0.63, its recall was true 0.63 and false 0.75, and its F1-Score was true 0.68 and false 0.68. The precision of Random Forest was true 0.82 and false 0.61 and its recall was true 0.61 and false 0.82, and its F1-Score was true 0.70 and false 0.70. The precision of the CNN was true 0.82 and false 0.73, its recall was true 0.75 and false 0.80, and its F1-Score was true 0.78 and false 0.76. CNN model's performance was highest. Consequently, this study confirmed that EEG-based data is valid for identifying the interview applicants' integrity. In addition, this study is expected to provide important clues that can be helpful in the development and implementation of an EEG-based AI recruitment system.

Therefore, it is said that identifying interview applicants' integrity is almost impossible in reality and reaching reasonable decision making is unoffordable through interviewing in terms of accurate assessmment of applicants' job skills and competencies. Second, there exists an unsolved debate over the intrinsic bias of algorithms which is mounted on AI recruitment systems. The algorithm of the AI recruitment system is trained with a training dataset which consists of mental and physical (psychosomatic) responses which are obtained from workers with excellent job performance who applied to mock interviews. In other words, there could be inevitability that the training dataset may be affected by the collective or hierarchical bias of excellent job performers who are evaluated by the existing recruitment processes from the beginning of collecting training dataset. Therefore, it would be making a hasty judgment to vaguely conclude that AI recruitment system will objectively increase fairness without sufficient confidence in the fairness and transparency of its algorithm. Third, a deep learning-based AI recruitment system, which has recently attracted a greal deal of attention, has a problem of social reliability suspected by the fact that it is impossible to logically explain the cause and effect relationship to determine the final pass-or-fail of job applicants. Although AI is an excellent analysis technology that collects and processes and analyzes big data to find hidden patterns, correlations, and give insights into big data, it is truly impossible as yet to logically explain cause and effect relationship at each stage of data analysis until the analysis results are concluded. The existing AI recruitment system was developed based on a machine learning model, a complicated technology that analyzes voice and face images with big data. However, the interview evaluation method of the AI recruitment system adopted so far has a limitation in that it cannot accurately determine the applicants' answer truthfulness during interviews. To solve the applicants' integrity problem in this study, an EEG-based biological experiment was proposed to more objectively explore the criteria for determining integrity by focusing on how to identify either the truth or falsehood of applicant's answers. The experimental design of this study was based on such EEG signal that its biological experiment was conducted to collect 14 channels of EEG signals between brain activity patterns over brain regions to set up a research methodology which is useful in identifying the truth or falseness of the interviewees' answer. Decision Tree, Random Forest, and CNN models were used as classification models to compare and analyze the experimental results of this study. By evaluating the performance of the three classification models, it was found that Decision Tree model's precision was true 0.68 and false 0.63, and its recall was true 0.42 and false 0.82, and its F1-Score was true 0.54 and false 0.71. In case of Random Forest model, its precision was true 0.63 and false 0.69, and its recall was true 0.67 and false 0.65, and its F1-Score was true 0.65 and false 0.67. In case of CNN model (Adam optimizer), its precision was true 0.62 and false 0.70, and its recall was true 0.69 and false 0.62, and its F1-Score was true 0.66 and false 0.66. In case of CNN model (SGD optimizer), its precision was true 0.53 and false 0.79, and its recall was true 0.60 and false 0.71, and its F1-Score was true 0.71 and false 0.60. In case of CNN model (RMSprop optimizer), its precision was true 0.77 and false 0.61 and its recall was true 0.34 and false 0.91, and its F1-Score was true 0.47 and false 0.73. Comparing performance results showed that Decision Tree, Random Forest, and CNN models all showed similar performance. However, CNN model's performance was relatively more excellent among them. To investigate from a demographic perspective, the analysis of 10 job seekers' EEG data was conducted and CNN model showed better performance in all of the three classification models than compared with the analysis of the total data consisting of 57 people who participated in this study's experiment whether job seeker or not. In that comparion, the precision of the Decision Tree was true 0.75 and false 0.63, its recall was true 0.63 and false 0.75, and its F1-Score was true 0.68 and false 0.68. The precision of Random Forest was true 0.82 and false 0.61 and its recall was true 0.61 and false 0.82, and its F1-Score was true 0.70 and false 0.70. The precision of the CNN was true 0.82 and false 0.73, its recall was true 0.75 and false 0.80, and its F1-Score was true 0.78 and false 0.76. CNN model's performance was highest. Consequently, this study confirmed that EEG-based data is valid for identifying the interview applicants' integrity. In addition, this study is expected to provide important clues that can be helpful in the development and implementation of an EEG-based AI recruitment system.
