BTMS 효율은 냉각 plate의 성능과 냉각 과정에서 소모되는 펌프의 소비전력으로 산정될 수 있다. 3장에서는 4개의 냉각 채널이 있는 냉각판을 사용하는 배터리 열 관리 시스템에 적용하는 실험을 수행하여 AI 모델에 대한 샘플 데이터를 수집하였다. 시험에 사용된 각 모듈에서 36개의 배터리가 냉각판에 통합된 원통형 핀 내에 배치되어 있다. 실험 운전을 위해 워터 펌프는 인버터에 의해 수동으로 제어하였다. 작동 배터리 온도 변화는 4가지 C-rate(2C, 4C, 6C, 8C) 조건에서 실험이 수행되었다. 배터리 온도는 인버터를 통해 흐르는 물의 냉각수량을 조절하여 30oC (±2oC)로 유지된다. 펌프의 회전수는 인버터의 주파수변환에 의해 제어되어 냉각수의 유량을 0.2에서 5.3 LPM으로 조절하였다. 워터 펌프의 소비전력은 파워 미터로 실험적으로 측정하여 냉각 시스템의 에너지 사용 효율을 산정하였다. 인버터의 최적 주파수는 배터리 온도가 충 방전 시 30oC (±2oC)의 원하는 목표 값으로 유지될 때 결정되어진다. 온도 변화, 펌프 주파수, 펌프 전력 소비 및 시간에 따른 기타 매개변수들은 BTMS 최적 제어를 위한 AI 모델을 개발하는 데 사용된다. 4장에서는 배터리 열 관리 시스템을 시뮬레이션하기 위해 MATLAB/Simulink Simscape 도구 상자(버전 R2020b)를 기반으로 battery thermal management system 모델을 개발하였다. ANN은 상호 연결된 뉴런 단위로 구성된 적절한 신경 아키텍처에 의해 변수 간의 복잡한 관계를 나타낸다. PR은 독립변수 x와 종속변수 y의 관계를 n차 다항식 곡선으로 표현한다. RFR은 단일 모델보다 더 정확한 예측을 위해 기계 학습 알고리즘의 예측을 결합하는 앙상블학습 방법(Ensemble learning method)을 사용한다. RFR-PR 모델의 조합은 모델의 예측 성능을 향상시키기 위해 수행된다. 모델의 예측 성능은 Mean Square Error (MSE), Mean Absolute Percentage Error (MAPE) 및 coefficient of determination (R2)를 사용하여 비교 및 평가된다. 실험에서 얻은 데이터 세트는 70%의 training (훈련), 15%의 validating (검증) 및 15%의 testing (테스트) 나뉜다. 모델의 비고는 보다 높은 R2, 보다 낮은 MSE 및 낮은 MAPE로 높은 예측 성능 지수로 판단하게 된다. 단일 RFR 모델과 RFR-PR 모델을 이용한 콘덴서의 Nusselt 수(Nu) 예측은 RFR 모델에 비해 RFR-PR 모델의 예측 성능이 더 우수 하게 구현되었다. 그 결과 RFR-PR 모델은 RFR 모델의보다 9.37% 더 높은 0.96 R2를 얻었고 86.36% 낮은 1.5x10-3 MSE를 얻었고 RFR-PR 모델의 MAPE는 2.99로 RFR 모델의 MAPE보다 56.79% 낮은 값을 얻었다. 아울러 본 연구에서는 펌프 주파수(F)를 예측하기 위해 ANN 모델과 RFR 모델과 RFR-PR 모델을 사용 비교 분석 하였다. ANN 모델의 경우 각각 0.9995, 5.1x10-5 및 0.167이다. RFR-PR 모델의 경우 각각 0.9998, 2.1x10-5 및 0.033이다. RFR 모델의 경우 0.9996, 3.7x10-5, 0.045이다. 따라서 ANN 모델과 비교하면 MSE, MAPE, R2은 RFR-PR 모델에서 각각 58.82%, 80.23%, 0.03%, REF모델은 각각 27.45 %, 73.05%, 0.01% 우수한 결과를 나타냈다. 따라서 결론적으로는 배터리 냉각 시스템의 펌프 인버터 제어에는 RFR-PR 모델이 가장 우수한 결과를 나타냈다. 향후 연구를 위해 6장에서 최적의 배터리 열 관리 시스템 제어 모델 구현 안을 제시하였다. 실시간 변수를 활용하여 냉각 시스템의 상태를 추정하고 배터리 냉각에 적정한 펌프 모터의 인버터 주파수 변화를 제어 구현하고자 한다.

Lithium-ion batteries (LIBs) are one of the most commercially popular power sources for electric vehicles (EVs), hybrid electric vehicles (HEVs), and Energy Storage Systems (ESSs) due to their outstanding performances such as high specific energy, high power energy density and superior performance compared to other driving power sources. However, LIB performance and lifetime are very sensitive to the variation of operating temperature. Whereas heat generation is an unavoidable problem that consistently occurs during the battery operating process. A battery thermal management system (BTMSs) is essential to control the battery temperature to guarantee the battery operates at the highest performance and to extend the battery life cycle and the safety of users. In the BTMSs, various methods have been studied such as air cooling, water cooling, and phase change materials. In this research, a battery thermal management system for INR18650-30Q cylindrical type cell is investigated using a liquid cooling method. The BTMS efficiency is estimated by cooling performance as well as pump power consumption due to the cooling process. In Chapter 3, a battery thermal management system using a cold plate with four cooling channels is experimentally investigated to collect the sample data for the AI model. In each battery pack investigated, 36 batteries are placed in cylindrical fins which are integrated into the cold plate. For the experiment operation, a water pump is controlled by an inverter manually. Operating battery temperature variations are investigated in conditions of four C-rates (2C, 4C, 6C, 8C). The battery temperature is maintained at 30°C (±2^o C) by modifying the cooling capacity of the water flow through the inverter. Pump power consumption is controlled by inverter frequency to vary the water flow rate from 0.2 to 5.3 LPM. The pump power consumption is measured experimentally by a power meter to estimate the energy efficiency of the cooling system. An optimal frequency of the inverter is obtained when battery temperature has remained at the desired value of 30°C (±2^o C) obtained at each charge/discharge rate. Temperature variation, pump frequency, pump power consumption and other parameters with time are used to develop AI models for the BTMS optimal control. In Chapter 4, a battery thermal management system model is developed based on MATLAB/Simulink Simscape toolbox (version R2020b) to simulate the battery thermal management system. MATLAB is a very powerful tool for numerical computation and data analysis. The battery pack is built based on the Electric Vehicle battery cooling system model to simulate the configuration of the cold plate. The battery pack consists of 4 battery modules including 36 single RC cells in each module. The battery temperature characteristics and thermal resistance are evaluated to investigate the cooling performance whereas pump power consumption is considered as the energy efficiency of the cooling system. The accuracy of the simulation is verified by previous experimental results. The thermal resistance of the battery is obtained at a constant value of 0.001 at each C-rate. Besides, the pump power consumption significantly increases as the C-rate increases. As higher C-rate operating, the faster frequency of the pump (F) operates to increase the water flow rate to cooling channels in the cold plate. Artificial intelligence is one of the most powerful tools for computer-based learning and data analysis and is applicable in several science and technology researches. In Chapter 5, Artificial neural network (ANNs) technique and the combination model of Random Forest Regression and Polynomial Regression (RFR-PR) algorithms are used to predict the frequency of the pump (F). ANNs represent the complex relationship between the variables by proper neural architecture consisting of interconnected units of neurons. PR expresses the relation between independent variable x and dependent variable y as a nth degree polynomial curve. RFR uses the ensemble learning method which combines predictions from machine learning algorithms for a more accurate prediction than a single model. The combination of RFR-PR model is conducted to improve the prediction performance of the model. The prediction performances of models are compared and evaluated by using mean square error (MSE), mean absolute percentage error (MAPE) and coefficient of determination (R2). Dataset obtained from the experiment is divided into 70% training, 15% validating and 15% testing. The prediction of Nusselt number (Nu) for condenser using single RFR model and RFR-PR model is implemented to prove the better prediction performance of RFR-PR model compared to RFR model. As the result, RFR-PR model the RFR-PR model obtained 0.96 R2, which was 9.37% higher than that of the RFR model and 1.5x10-3 MSE, 86.36% lower than MSE of RFR model, while MAPE of RFR-PR model is obtained at 2.99, 56.79% lower than MAPE of RFR model. Therefore, in conclusion, the RFR-PR model showed the best results for the pump inverter control of the battery cooling system. For future works, a proposal for an optimal control model for the battery thermal management system is presented in Chapter 6. Real-time variables are utilized to estimate the state of the cooling system and control the required variation of frequencies of the pump motor via the inverter.
