최근 한국의 4대강을 비롯하여 전 세계적으로 유해 남조류로 인한 녹조현상의 발생 빈도와 강도가 증가하고 있다. 이러한 녹조현상의 부산물인 스컴, 냄새물질 등은 수자원의 이용을 방해하고, 심미적인 문제를 야기하며, Microcystic, Anabaena, Oscilatoria, Aphanizomenon 등 유해 남조류 종이 배출하는 간 독성, 신경 독성 등의 독성물질은 인간과 동물의 건강에 큰 위협을 줄 수 있다. 녹조 현상에 대한 적절한 초기 대응을 위해서는 녹조 현상의 모니터링이 매우 중요하다. 현재 우리나라에서는 직접 채수를 통한 담수역의 수질 모니터링을 진행하고 있으나, 이러한 직접 채수를 통한 점 단위 모니터링은 시간과 인력의 소요가 큼은 물론, 유해 남조류의 공간적인 분포와 거동의 파악에는 한계가 존재한다. 최근에는, 이와 같은 한계를 극복하기 위해 초분광 영상을 이용하여 수질을 면 단위로 모니터링하는 연구가 지속적으로 수행되고 있다. 한국에서도 항공 초분광 센서를 이용하여 녹조현상을 원격 모니터링하기 위한 사업이 시험적으로 적용되었으며, 운영되고 있으나, 수백 개의 연속적인 분광 파장에서 최적의 분광 파장 조합을 찾는 것은 어렵다. 딥 러닝 기반 모델은 데이터 기반으로 스스로 중요한 특징을 추출할 수 있으며, 동시에 추출된 특징을 기반으로 모델링 목적에 따라 예측, 분류, 군집화 등의 작업을 수행할 수 있다. 따라서 본 연구에서는 좀 더 효율적인 원격탐사를 이용한 녹조현상 모니터링을 위해 기존 방법론의 한계점을 개선하여 사전 지식과 인력의 요구를 최소화하고, 분광 파장의 선정과 예측을 동시에 수행할 수 있으며, 항공 영상에 대한 적용성을 증대시킬 수 있는 딥 러닝 기반의 새로운 방법론을 제안 하였다. 또한, 연구 대상지역인 금강 백제보 상류의 딥 러닝 기반 방법론의 활용을 통한 녹조현상에 대한 면 단위 모니터링의 가능성에 대해 고찰하였다. 본 연구에서 제안하는 딥 러닝 기반 예측 모델인 Stacked autoencoder deep neural network(SAE-DNN)은 특징 추출을 위한 Stacked autoencoder와 남조류 색소 농도 예측을 위한 Simple perceptron이 결합된 구조로 현장측정 원격반사율 데이터를 입력값으로 받아 남조류 색소 농도를 예측한다. 기존 방법론 및 단순 심층신경망과의 예측성능 비교 결과, SAE-DNN 모델은 R2가 0.87, RMSE가 14.45μg/L, 상대적 RMSE가 86.42%로 우수한 모델 성능을 나타냈다. 상대적 중요도 분석을 통해 남조류 색소 농도 예측을 위한 주요 분광 파장들, 538nm, 596nm, 735nm를 선정할 수 있었다. 선정된 주요 분광 파장들은 각각 녹색광의 반사율, 남조류 고유 색소의 흡광도 피크 등의 정보를 담고 있는 것으로 보고된 바 있으며, 주요 분광 파장 만을 입력값으로 하는 SAE-DNNPeaks를 통한 남조류 색소 농도 예측은 R2가 0.88, RMSE가 14.36μg/L, 상대적 RMSE가 85.88%로 모든 분광 파장을 입력값으로 하는 SAE-DNN과 흡사한 예측성능을 나타냈다. 이와 같은 결과를 통해 데이터 기반으로 유의미한 분광 파장을 선정할 수 있음을 확인 했다. 항공 영상을 입력값으로 하는 SAE-DNNPeaks의 경우 수용 가능한 수준의 예측 성능을 나타냈지만, 남조류 색소 농도를 과소추정하는 경향이 뚜렷했다. 이와 같은 결과는 상대적으로 남조류가 번성했던 시기에 시행된 모니터링이 적은 것과, 대기 보정 기법의 영향으로 인한 것으로 생각할 수 있다. 하지만, 항공영상에 대한 면 단위 모니터링 결과 녹조현상이 심하게 발생했던 연구 대상지역 하류 부분에서의 고농도 남조류 색소 농도를 성공적으로 추정하는 것을 확인할 수 있었다. 본 연구에서 제안된 SAE-DNN의 적용은 사전 지식과 인력의 요구 없이 데이터 기반으로 주요 분광 파장의 선정과 남조류 색소 농도의 예측을 동시에 수행 가능했으며, 기존 방법론에 비해 높은 예측 성능을 나타냄은 물론, 유의미한 분광 파장을 선정할 수 있음을 확인했다. 따라서, 딥 기법의 사용은 항공 영상에 대한 적용성 증대는 물론, 더 나아가 중요 분광 파장만을 측정함으로써 초분광 영상 데이터 수집의 부담을 감소시키는 데도 일조할 수 있을 것으로 판단된다.

Recently, the frequency and intensity of algal bloom due to harmful cyanobacteria are increasing worldwide, including the 4 major rivers in South Korea. The by-products of algal bloom, such as scum and odorous substances affects the intended use of wawter and cause aesthetic problems. In addition, hepatotoxicity and neurotoxicity produced by harmful cyanobacteria such as Microcystis, Anabaena, Oscilatoria, Aphanizomenon can pose serious threat to human and animal health. From a management perspective, monitoring harmful cyanobacteria abundance plays a crucial role in taking timely actions against harmful algal bloom at an early stage. The government is now conducting monitoring of water quality in inland water through direct sampling. However, the point monitoring through direct sampling is not only time consuming and labor intensive, but also has limitation in understanding spatial distribution and behavior of harmful cyanobacteria. In order to overcome such limitation, remote sensing-based techniques to monitoring the excess of cyanobacteria are studied consistently. Recently, a program for remotely monitoring harmful cyanobacteria blooms using airborne hyperspectral sensors has been employed and operated on a trial basis in South Korea but the selecting optimal combination of spectral bands among the hundreds of continuous, correlated bands is challenging. Deep learning-based model can learn important features from data without domain knowledge and can perform prediction, classification and clustering according to the modeling purpose. Therefore, this study proposed a new deep learning-based modeling for more efficient remote sensing-based monitoring of harmful algal bloom that can improve the limitation of existing methods by minimizing domain knowledge and manpower requirements, selecting important bands and predicting cyanobacteria pigments simultaneously, and improve applicability to airborne imagery. Furthermore, the applicability of the deep-learning based modeling to surface monitoring using airborne hyperspectral imagery was examined. Stacked autoencoder deep neural network(SAE-DNN), which is a deep learning-based prediction model proposed in this study, is composed of a stacked autoencoder for feature learning and a simple perceptron for predictive learning for predicting the concentration of cyanobacteria pigment by in-situ reflectance data. As a result of comparing the existing methods and the simple deep neural network(DNN), the performance SAE-DNN was superior tham other methods with an R2 of 0.87, RMSE of 14.45μg/L, and relative RMSE of 86.42%. By using relative variable importance analysis yielded the most useful spectral bands, namely 538nm, 596nm, and 735nm. The selected useful spectral bands have been reported to contain information about reflectance of green light and absorbance peak of cyanobacteria pigment. The prediction accuracy of the SAE-DNNPeaks, using only the aforementioned spectral bands as input variables, was comparable to that of SAE-DNN. These results show that the useful spectral bands can be selected by data based method. The application of the SAE-DNNPeaks to airborne hyperspectral image data resulted in an acceptable prediction accuracy, but there was a tendency to underestimate the cyanobacteria pigment concentration at high cyanobacteria pigment concentration. These results potentially arising from less monitoring performed during the relatively prosperous period of the cyanobacteria and uncertainty associated with atmospheric correction. However, the result of surface monitoring using airborne spectral data show that the concentration of cyanobacteria pigment in the lower part of study area, where the harmful algal bloom occurred sevelry, was successfully estimated. The application of SAE-DNN, which is proposed methodology in this study, enables to select the useful spectral band and predicting cyanobacteria pigment concentration simultaneously without requirement domain knowledge and manpower, and show superior prediction performance than existing methodologies. Therefore, the application of deep learning-based model not only can improve the applicability to airborne imagery but also can reduce the burden of the obtain hyperspectral data by selecting and obtain only the useful bands.
