In this paper, was studied anomaly detection for wheel flats. If wheel flats occur they can damage to the bogie devices and affect the passengers ride quality. Train operating companies in the Korea, wheel flats are detected by checking wheels one by one with their eyes after railway vehicles come into the railway vehicle depots. So, it is difficult to check 80 wheels in one formation of 10 cars. Therefore, condition-based maintenance (CBM) for wheel flats would be necessary to focus on more important parts for maintenance, to increase work efficiency and to secure driving safety and ride quality. This paper, studied on the anomaly detection for wheel flats in railway vehicles, using CNN (Convolution Neural Networks) among the deep learning algorithms. In the case of railway vehicles, it is difficult to obtain actual failure data through a running vehicle due to problems in passenger safety and cost. For this reason, first, the vibration acceleration was obtained using SIMPACK, a multibody dynamics simulation software of Dassault Systèmes. Second, since the signal cycle of a wheel flat changes according to velocity when the railway vehicles are in actual running state, order analysis was added before STFT (Short Time Fourier Transform) to convert from time-domain to angular-domain. Third, after order analysis, STFT was performed to convert the spectrogram image, and then the image for the wheel flat signal per wheel was resized to 32 X 32. Fourth, the anomaly detection of wheel flat was performed using CNN. Above all, in order to proceed with this paper study, time domain data without signal processing and spectrogram images obtained through STFT were learned using the LeNet model modified with the pooling method and activation function to improve performance and speed in the existing LeNet-5 architecture. As a result, it was confirmed that the method through the spectrogram showed higher accuracy than the time domain data. At this time, since the noise signal is not included in the case of vibration acceleration obtained through simulation, the noise signal obtained from the Seoul Metro Subway Line 7 vehicle was superimposed with the signal obtained from the simulation. The wheel flat signal including the noise signal was converted to a spectrogram image through STFT, and this image was also used for learning, confirming that it was possible to detect anomalies even in wheel flat signal containing noise. Next, the previously used LeNet model and the ResNet20 model were comparatively analyzed, and it was confirmed that the LeNet model was more suitable for this study because of its higher accuracy and recall values and higher AUC (Area Under the Curve). Finally, because it is difficult to obtain failure data due to the periodic parts replacement and maintenance for mechanical parts in railway fields. This paper compared and analyzed the LeNet model used above, which is a supervised anomaly detection model, and the Deep SVDD model, which is an unsupervised anomaly detection model that learns only normal data. Although the supervised anomaly detection model was high in all aspects except for accuracy, the unsupervised anomaly detection model, which has an accuracy of 94% and a recall value of 0.869, was also judged to be a meaningful analysis method in the railway field, where it is difficult to acquire failure data.
