Chemical substances play a critical role in modern industries and daily life, but they can leak due to unexpected accidents during handling, transportation, and usage. Such chemical leakage accidents can pose severe risks, such as fire, explosion, and toxicity to the human body, so early detection of chemical leakage accidents is recognized as an important task to protect industrial safety and human life and health. If a chemical leak is not detected quickly and accurately at an early stage, the accident can rapidly escalate and increase the risk, thereby necessitating a system capable of detecting leakage early in the event of an accident and responding quickly. Most industrial sites aim to prevent such leakage accidents by deploying sensors. However, current domestic and foreign regulations operate on a uniform distance standard, such as installing one per 10m or 20m, resulting in insufficient quantitative damage impact assessment. Recent studies propose sensor placement optimization based on risk using Computational Fluid Dynamics (CFD) simulations, but the high computational cost and need for expertise of CFD make it difficult to use efficiently. This study proposes a surrogate model to replace high-cost CFD and a framework for sensor placement optimization based on quantitative damage impact assessment using this model. The proposed surrogate model is designed based on differentiable physics (DP), which allows automatic differentiation of the deep learning framework, thereby reducing computational costs compared to traditional CPU-based simulators. Using data derived from the DP-based surrogate model, a super-resolution was performed using a CNN-based model, which improved the resolution by four times, thus proposing a more efficient quantitative damage impact assessment system. Through the utilization of a development system, a multitude of simulation big data was generated, and subsequently, a sensor placement optimization based on MILP (Mixed Integer Linear Programming) formulation was proposed. The current proposed system undertook the optimization of placement to minimize the detection time for various leakage scenarios. In the case study, representative obstacles in the form of spherical and box shapes in a chemical plant were reflected. Simulation was conducted in 2D and 3D using a DP-based proposed surrogate model. It was confirmed that the resolution of leakage scenarios could be improved through deep learning-based super-resolution. During the placement optimization stage, placement optimization was conducted using 3D leakage scenario data derived from CFD simulations and the surrogate model, and the performance of the proposed surrogate model was verified by comparing the results. Through the proposed framework of this study, it was confirmed that the high-cost traditional CFD simulation can be replaced, and an efficient and quantitative damage impact assessment of chemical substance leakage accidents is possible. Also, by considering multiple leakage scenarios and minimizing detection time through sensor placement, it is expected to contribute to safety in the field of handling chemical substances.
